Course Objective & Scope
Even a model with high aggregate accuracy can systematically disadvantage specific customer segments, make overconfident errors on out-of-distribution inputs or breach regulatory mandates (GDPR, banking supervision, EU AI Act) when pushed straight to production. Responsible deployment turns high-level governance principles into concrete engineering controls inside CI/CD and serving pipelines.
This course covers subgroup fairness auditing (Fairlearn), local decision explainability (SHAP and reason codes), probability calibration and uncertainty bounds with Conformal Prediction, deterministic input/output guardrails, shadow and canary rollouts, and automated kill-switch/fallback circuits. Participants design a responsible deployment gate and safety wrapper for a high-impact model in their organisation.
Who Should Attend?
- ML and MLOps engineers deploying models in high-stakes domains such as credit, insurance, hiring, pricing and healthcare
- Model validation, risk management and AI governance specialists
- Technical leads accountable for the safety, compliance and auditability of production AI systems
- Prerequisite: Python and experience evaluating machine learning models
Key Takeaways
- Audit subgroup performance disparities and bias in pre-deployment CI gates using Fairlearn
- Expose local SHAP attributions and human-readable reason codes alongside every high-impact prediction
- Use probability calibration and Conformal Prediction to abstain and route uncertain cases to human review
- Wrap models in deterministic input/output guardrails that catch out-of-distribution payloads and policy violations
- Execute safe shadow/canary rollouts backed by immutable decision audit logs and instant kill-switch fallbacks
Curriculum
Pre-Deployment Stress Testing and Subgroup Fairness
- Risks hidden by aggregate metrics: auditing demographic parity, equalized odds and cohort slices with Fairlearn
- Post-processing threshold optimisation and curating adversarial/edge-case test suites
Real-Time Explainability and Adverse-Action Reason Codes
- Generating low-latency local explanations with TreeSHAP/FastSHAP and mapping them to clear reason codes
- Counterfactual explanations and meeting regulatory transparency requirements (GDPR, banking rules, EU AI Act)
Probability Calibration, Conformal Prediction and Human Escalation
- Calibrating raw scores into true probabilities via Platt scaling and isotonic regression
- Distribution-free uncertainty intervals with Conformal Prediction (MAPIE) and automatic abstention to human review
Inference Guardrails and Out-of-Distribution (OOD) Protection
- Pre-inference range checks and catching anomalous inputs before scoring via Mahalanobis/isolation models
- Post-inference deterministic business caps, monotonicity constraints and safety filters
Progressive Rollouts, Kill-Switches and Immutable Audit Trails
- Shadow-mode validation, staged canary traffic ramps and automated rollback triggers
- Designing instant kill-switches that fall back to deterministic heuristics, plus tamper-evident decision audit logs
